Introduction to Reinforcement Learning /
What is the nature of intelligence? This question has puzzled philosophers and scientists for millennia, yet in computer science, a more pragmatic question is driving revolutionary advances: How can machines learn to make good decisions? The importance of this question lies in its connection to one of the core challenges of artificial intelligence—enabling computer systems to autonomously select optimal actions in complex, dynamic, and uncertain environments. Reinforcement Learning is precisely the research field that emerged to answer this question, representing a fundamentally different paradigm of machine learning that distinguishes itself from traditional supervised and unsupervised learning approaches.
In the landscape of traditional machine learning, supervised learning occupies a dominant position. This paradigm relies on large amounts of labeled data, where algorithms learn the mapping between inputs and outputs to make predictions. For instance, given tens of thousands of images with cat/dog labels, a supervised learning algorithm can be trained to classify animals in new images. Unsupervised learning focuses on discovering hidden structures and patterns in unlabeled data, with clustering algorithms and dimensionality reduction techniques as typical examples. While these methods have achieved remarkable success in image recognition and natural language processing, they share a fundamental limitation: they are essentially reactive, capable only of producing outputs given inputs, but unable to actively interact with the environment, learn from the consequences of actions, or plan a sequence of actions to achieve long-term goals.
Reinforcement learning provides a fundamentally different learning mechanism. In the RL framework, an agent learns through continuous interaction with the environment: the agent observes the environment's state, selects and executes an action, and the environment provides feedback—typically some form of reward or penalty—and transitions to a new state. This seemingly simple interaction loop contains profound implications for machine intelligence because it introduces temporal dimensions and causal relationships. An agent must not only make decisions based on current states but also consider how current decisions affect the future; it must pursue not only immediate gains but also balance long-term returns. This capability for sequential decision-making is precisely what makes reinforcement learning a critical technology on the path toward artificial general intelligence.
Understanding the unique value of reinforcement learning requires first situating it within the broader framework of machine learning through comparative analysis. Machine learning, as the core driver of artificial intelligence, is typically divided into three major paradigms: supervised learning, unsupervised learning, and reinforcement learning. These three paradigms differ significantly in data requirements, learning objectives, feedback mechanisms, and application scenarios, with each paradigm being most suitable for particular problem domains.
Supervised learning is the most mature machine learning paradigm, with its core task being to learn a mapping function from input features to output labels. In supervised learning, training data consists of pairs of (input, output) samples, and algorithms optimize model performance by minimizing the error between predicted outputs and true outputs. Classification problems (such as image recognition and spam detection) and regression problems (such as house price prediction and temperature forecasting) are typical applications of supervised learning. The learning process of supervised learning algorithms is driven by explicit external guidance signals—the expected correct answer is included with each training sample, which is the origin of the term "supervised." Deep learning models such as Convolutional Neural Networks (CNN), Recurrent Neural Networks (RNN), and Transformer architectures have demonstrated powerful expressive capabilities in supervised learning tasks, driving revolutionary advances in computer vision and natural language processing.
However, the application of supervised learning is severely constrained by the cost and quality of data labeling. In many real-world scenarios, obtaining large-scale, high-quality labeled data is prohibitively expensive, and in some domains (such as medical diagnosis and legal judgment), there are no standard answers at all. Furthermore, supervised learning models typically can only handle offline, pre-defined tasks, struggling to adapt to environmental changes or achieve cross-task generalization. These limitations have driven researchers to seek new learning paradigms.
Unsupervised learning aims to extract valuable knowledge and structure from unlabeled data. Unlike supervised learning, unsupervised learning has no explicit output labels as learning signals; instead, it relies on the inherent properties of the data itself for learning. Clustering algorithms group similar data points together, with typical methods including K-means, hierarchical clustering, and density-based approaches; dimensionality reduction techniques map high-dimensional data to lower-dimensional spaces while preserving key structural information, with Principal Component Analysis (PCA) and t-SNE as representative algorithms; generative models learn the data distribution to generate new samples, with Variational Autoencoders (VAE) and Generative Adversarial Networks (GAN) as groundbreaking achievements in this field. Unsupervised learning plays an important role in data exploration, anomaly detection, and feature learning, but its learning objectives typically lack clear task orientation, making it difficult to directly solve problems requiring decisions or actions.
