From Rule-Based Systems to Data-Driven Approaches: Three Stages of AI Development
Artificial Intelligence (AI), as a branch of computer science, can trace its development back to the 1950s. Over the past seventy years, AI has experienced multiple cycles of boom and bust, forming several distinct developmental stages. Each stage represents a deepening of human understanding of the nature of intelligence, bringing new technological paradigms and challenges.
Stage One: The Era of Expert Systems (1956-Early 1980s)
The birth of AI is typically marked by the 1956 summer workshop at Dartmouth College. In this early stage, researchers attempted to simulate human reasoning by manually writing rules. This approach gave rise to so-called "expert systems," which encoded domain-specific knowledge into large collections of if-then rules, expecting to solve problems through logical inference.
Typical examples of expert systems include the MYCIN system for infection diagnosis, the R1 system for computer system configuration, and the DENDRAL system for assisting chemical research. The common characteristic of these systems is high transparency—the decision-making process can be fully traced and understood, because each step of reasoning is based on clearly defined rules. However, this approach also has fundamental limitations: it relies heavily on knowledge transfer from human experts, cannot learn automatically from data, and the management and maintenance of rule bases become extremely complex as system scale grows.
Stage Two: The Rise of Statistical Learning (1980s-2010s)
With the improvement of computing power and the accumulation of data resources, AI research gradually shifted toward statistical learning methods. The hallmark breakthrough of this stage was the maturation of machine learning as an independent discipline. Researchers began to realize that instead of manually writing rules, it would be better to let computers automatically extract patterns from large amounts of data.
In the era of statistical learning, algorithms such as decision trees, support vector machines (SVM), naive Bayes classifiers, and logistic regression became mainstream. These models performed well in terms of interpretability. For example, decision tree models classify data through a series of yes/no questions, and each decision step can be clearly visualized and understood. Decision-makers can trace the source of any prediction result along the tree's path and understand why the model made a particular prediction.
This period also witnessed the development of ensemble learning methods, such as Random Forests and Gradient Boosting Trees. Although these methods are more difficult to interpret than individual decision trees, their behavior can still be understood to some extent through feature importance analysis and model-level interpretation techniques.
Stage Three: The Deep Learning Revolution (2012-Present)
2012 can be considered the first year of the deep learning era. In that year's ImageNet image recognition competition, the convolutional neural network AlexNet, designed by Alex Krizhevsky, Ilya Sutskever, and Geoffrey Hinton, defeated traditional methods decisively, reducing image classification error rates from 25% to 16%. This breakthrough triggered comprehensive applications of deep learning in computer vision, natural language processing, speech recognition, and other fields.
The core features of deep learning are end-to-end learning and hierarchical representation. Unlike traditional machine learning that requires manual feature engineering, deep learning models can automatically learn hierarchical representations from raw data. Taking image recognition as an example, the first layer of a neural network might learn edge detection, the second layer learns texture recognition, higher layers learn shapes and object parts, and the final layer makes classification decisions.
This automatic feature learning capability has enabled deep learning to achieve superhuman performance on many tasks. However, this powerful representational ability also comes with a loss of interpretability. For a deep neural network with millions or even billions of parameters, its decision-making process is almost impossible for humans to understand directly. We know the input and output, but what happens in between—why the model made this decision—becomes a "black box."
The Tension Between Model Complexity and Interpretability
To understand why modern AI systems are difficult to interpret, we first need to clarify the relationship between model complexity and interpretability. Model complexity typically refers to the model's ability to fit complex patterns in data, while interpretability refers to the degree to which humans can understand the reasons for model decisions.
From a theoretical perspective, there exists a complexity-interpretability tradeoff. Simple models—such as linear regression or single decision trees—typically have good interpretability but limited expressive power, struggling to capture nonlinear relationships and high-order interaction effects in data. Complex models—such as deep neural networks or ensemble models—have powerful expressive capabilities but are very difficult to interpret.
This tradeoff can be understood through bias-variance decomposition. Simple models typically have high bias—they may systematically deviate from true data patterns—but low variance—they are not sensitive to random fluctuations in training data. Complex models are the opposite: low bias but hig
