The rapid advancement of artificial intelligence has fundamentally transformed various sectors of human society, from healthcare diagnostics and financial risk management to autonomous driving and judicial decision support. As intelligent systems increasingly influence decisions affecting life, property, and freedom, a critical question emerges: How much do we truly understand about the reasoning mechanisms behind these decisions? This lack of understanding may not merely be an academic curiosity but a fundamental bottleneck constraining the responsible development and deployment of AI systems.
Deep learning, as the dominant paradigm in contemporary AI, has achieved remarkable success across diverse domains including computer vision, natural language processing, and speech synthesis. Convolutional Neural Networks surpassed human-level performance on ImageNet benchmarks, Transformer architectures elevated machine translation quality to near-professional human translator levels, and reinforcement learning algorithms like AlphaGo defeated world Go champions. However, behind these remarkable achievements lies a stark reality: these models are essentially highly complex nonlinear functions with parameter counts reaching billions or even trillions. Large language models like GPT-4 are estimated to contain over 1.8 trillion parameters, and how their internal representations encode and process linguistic knowledge remains largely mysterious. This complexity renders model decision-making processes nearly impenetrable to human observers, creating the infamous "black box" problem.
The "black box" nature of deep learning models stems from multiple intertwined factors. From an architectural perspective, deep neural networks construct extraordinarily complex feature representations through layered nonlinear transformations. Consider a typical image classification convolutional neural network: the input layer receives raw pixel values, which then undergo dozens or even hundreds of alternating convolutional layers, pooling layers, and activation functions before the final classification probabilities emerge from fully connected layers. Throughout this multi-layer processing pipeline, information undergoes repeated abstraction and reorganization, with original pixel-level representations gradually evolving into highly abstract semantic features. While this hierarchical information processing mechanism endows models with powerful representation learning capabilities, it simultaneously renders it nearly impossible for humans to trace how a specific input progressively transforms into the final output. Any individual neuron or layer's activation lacks a clear human-interpretable meaning, as its significance is distributively embedded throughout the network's parameters.
From a scale perspective, contemporary deep learning models have reached dimensions that defy intuitive comprehension. ResNet-152 contains approximately 60 million parameters, BERT-Base comprises roughly 110 million parameters, GPT-3 spans 175 billion parameters, and the latest multimodal large models exceed one trillion parameters. Attempting to understand model behavior by directly analyzing weight values is analogous to trying to comprehend human cognition by examining the precise connection strengths of every neuron in the brain. This dual complexity—both in quality and quantity—renders traditional model understanding approaches, such as analyzing weights or visualizing decision boundaries, fundamentally inadequate in the deep learning era.
More fundamentally, the "unexplainability" of deep learning models arises from the essential characteristics of their learning process. Unlike traditional machine learning models, deep neural networks tend to learn latent reusable patterns and abstract representations from data rather than human-interpretable concept boundaries. Although this end-to-end learning paradigm grants unprecedented flexibility and generalization capability, it sacrifices model interpretability as the price. Features automatically discovered by models are typically highly distributed and superimposed—single concepts may activate combinations of multiple neurons, while individual neurons may participate in encoding multiple different concepts simultaneously. While such distributed representations partially mirror certain characteristics of biological neural systems, they fundamentally conflict with human conceptualization thinking patterns.
The opacity of deep learning models presents multifaceted risks beyond academic curiosity. First, fairness and discrimination risks emerge when models make high-stakes decisions in lending, hiring, or criminal justice. The unobservable decision logic may perpetuate systemic biases learned inadvertently from historical data. ProPublica's investigation of the COMPAS recidivism assessment tool revealed significantly higher false positive rates for African-American defendants, yet the model's unexplainable decision logic rendered such bias difficult to identify and rectify. Without interpretability, we cannot verify whether models base decisions on legitimate factors (like criminal history) or illegitimate factors (like race).
Second, reliability and safety risks accompany deep learning's documented vulnerability—adding nearly imperceptible perturbations to inputs (adversarial exampl
